What is the cheapest/simplest way to accomplish this? Make a circuit that will turn on the power to a device if it gets a pulse of current and let it on till it gets another? Note the “device” is a LED so no relays should be needed.

a low power SCR will do the job.

correct me if I am wrong here, but will the scr not just turn the voltage on? I need it to turn it off if it gets another pulse of current.

You didn't say that. You need a flip flop, check out SN7474 or CD4013.
